fundamentals of LLM: A story from history of GPTs to the future

Introduction:

So there has been a lot of developments in LLM and I have not gone through any of it. In the coming few parts, I will talk about LLM and its related eco-system that has developed and will try to reach to the cutting or more like bleeding edge.

Lets go through the main concepts first.

What is LLM?

LLM[1] refers to large language models; that refer to mainly deep learning based big transformer models that can perform the natural language understanding and natural language generation tasks much better than the previous versions of the models generated in NLP history.

LLM models are generally quite big, in terms of 10-100GBs and they can't fit in even in one machine's ram. So, most LLMs are inferenced using bigger GPU cluster systems and are quite computationally exhaustive.

What was the first true LLM?

The BERTs

Transformers were invented on 2017 by vaswani et al in their revolutionary paper called "attention is all you need". After that we had the BERT models, and a series of BERT models came out. BERT models were good in sentence interpretation, next best word prediction and other tasks. But BERT models were not able to generate long and comprehensive text pieces.

First of the GPTs

At the same time, openai had started working on their GPT series. GPT models came out first from 2018 in terms of GPT-1. GPT stands for generative pre-trained transformer. GPT-1 came with 117 million parameters. GPT-2 came out in 2019 with 1.5 Billion parameters. Even GPT-2 was possible to load in one PC and work with the model.

GPT-2 model was very good in generating sentences and comprehensive texts; and it was possible to generate comprehensive small paragraphs even with GPT-2.

But there were some problems with GPT-2 yet. The model used to get stuck in repetitive hell such as it would keep churning out the same tokens in series after a certain time; GPT-2 also would generate a lot of garbage characters sometimes. But GPT-2 was at par with the BERT models in many of the performance measures; as well as people started solving generative tasks with this model.

The winner steps in the arena

GPT-3 comes out on May,2020. GPT-3 was planned as to be a larger model of GPT-2 just scaled up; with a lot more parameters. GPT-3 had 175 Billion parameters; and among the models present in 2020, GPT-3 was the biggest. And GPT-3, in my humble opinion was the first true LLM. Because BERT had 110 million in its base-bert and 370 million parameters in BERT-large model. No model, at that time had so many parameters in it.

And OpenAI recognized the true game in the inception of GPT-3. This model, first time, felt as if we are talking to someone, not something. And the model had beat most of the NLP tasks. Be it, generation, question answer, summarization; you name it.

GPT-3 was though, not open-sourced. A company, named OpenAI, started as a non-profit and to guard AI from evils of big and bads, put their best model behind the bars of API based services. They started giving out API access on request basis.

The best and biggest researchers, industry impact folks got them first, then it was first come first serve. I remember applying for GPT-3 access back in 2020 november and receiving it in the beginning of 2021 feb.

The model was trained on reddit corpus and a big chunk of internet; and its performance was surreal. I had my fair share of work with GPT-2 based generation tasks and extractive and abstract summarization; and one sweep of the white and green playground of GPT-3 swept my feet off the ground.

GPT-3 though, still had some of the GPT-2's problems. GPT-3 used to still generate silly replies; and character garbage (a jumble of lot of characters); as well as repetitive sentences or tokens too. GPT-3, also needed the token limit on how many tokens to generate; and would generate dangling sentences a lot. This was one of the problems we would have to work around that time.

GPT-3 was unable to generate codes that were comprehensible too. GPT-3 would come up with good amount of blocks of codes, and they would work on small blocks too. But GPT-3 were not able to generate fully running codes yet. But it was possible to take help of GPT-3 for a simple coding problem; or also to generate a bulk to do debugging on it later.

The era of GOAT, chatGPT

GPT generated a instructgpt model; that is able to follow instruction and generate responses based on the instructions. The fine-tuning of chatGPT, a more conversion focused sibling model of the instructGPT, used the scale of the data from the previous GPTs but in increased scale; as well as reinforcement learning from human feedback (RLHF).

chatGPT started on 30 nov 2022; and to the new year of 2023, chatgpt the gpt 3.5 model and gpt 4 model became a new sensation world wide. it prompted a whole new culture of AI, and propelled the conversation about AI vs human with its human-ish capacity.

chatGPT has versions that passed medical and Bar exams, and can answer all your questions in particular or generic manner in whatever tones you prefer.

chatGPT, is the first version of the models in GPT series that is also able to generate codes very comprehensively. chatGPT, has become a productivity boost for everything in the world; and it has generated the new gold rush in human civilization since everyone thinks AI will be the new differentiator and learning how to best use chatGPT is the way to get the new metaphorical gold.

This chatGPT story will go is still evolving, with thousands of prompt books, courses, papers and researches every week. But for the scope of the article, we will move on from this and get into the next developments.

What are the trends that came up after invention of LLMs?

After ChatGPT, the mass and industry approached LLM with extreme interest. To quote Chip huyen[5],

"It’s easy to make something cool with LLMs, but very hard to make something production-ready with them."

Industry looked into using ChatGPT or similar LLM tools in production but from that arose a number of different problems; such as hallucination, lack of context, cost and latency, proper prompting techniques etc. we will discuss each of these ideas in details in the following section.

Before that, lets delve into the concept of prompting.

What is Prompting?

Prompting refers to the art/science of writing/crafting a prompt that provides correct instructions to the LLM model/software in order to get the desired output.

Why prompting is required to learn?

Upto the invent of LLM, programming used to be done in programming languages, where the syntax and formats made sure that the languages give exact instructions to the machine; i.e. the codes written were not upto interpretation or weren't subjective.

In case of LLMs, we provide the LLM a written natural language instruction text, which the LLM models process and provide output.

Now as you may know, LLMs are inside the hood a AI model that takes a text, processes it through its deep learning layers and provides an output. This process is stochastic, i.e. the output can vary based on each initiation of request, and there is a certain amount of randomness in the output. This randomness, or stochastic behavior of LLMs create random and different outputs from an LLM.

Now imagine you are trying to score a essay question, or trying to underwrite someone's credit worthiness using a LLM model. What if someone was rejected 5 times when you asked the LLM for a loan and then 6th time they are approved?

will that be an acceptable model? never.

Also, the problem we just described, where we can't expect a consistent output from an LLM model, is called the self-consistency problem of LLM.

LLMs also are seen to answer questions incorrectly or without "much thinking", in case of simple prompting techniques; or would not pick up tones, formats, guidances without proper way of prompting.

These are the reasons why one lane of research went into finding how to prompt, what are the different prompting techniques, how to get consistent output from a stochastic model etc. We will discuss the details of prompting techniques in a later post.

What is hallucination?

One of the biggest problems that came up when people started asking LLMs all sorts of question was that LLMs started lying.

Yes, if you haven't seen it first hand, a LLM model can lie a lot. Whenever you ask it a question, that it doesn't know about inherently, or wasn't trained on; it can "cook up" an answer to that question out of its concepts and it will silently write it without giving you any warning, or saying that I don't know about this.

This problem arises from the structure of an LLM again. LLM, inherently a language model, doesn't have the concept of not knowing. It still generates the next best words repetitively to get a whole answer out of it. But not knowing an answer is a different concept, a discriminative concept. So what LLM does when it comes across a question it doesn't know the answer to? it predicts the best sounding answer according to its learnings.

ChatGPT currently doesn't do that as much as GPT3 used to do, but it is still possible to get hallucination answers to it. The way OpenAI solved it or attempted to solve it for chatgpt is they added guardrails i.e. softwares that monitors and corrects, improves or changes the raw outputs based on common sense and other needs.

A lot of other models hosted by services that compete with chatgpt have also put fact checking system to put in real facts along with machine generated result as well as check their answer for hallucinations thoroughly.

Hallucinations can also hurt your usecase specifically when you use chatgpt in a very specific information usecase. For example, if there was a chatbot in airline tickets service system that used chatgpt, and that service start cooking up flight numbers when asked about flight from location A to location B, then soon the airline will have to shut down their services out of the lawsuits they will get.

Hallucinations and other reasons led to one of the biggest research trends in LLMs in current days(the time of writing april,2024), which is RAG.

What is RAG?

RAG or retrieval augmented generation, is a process or framework to optimize the output of LLM model using an authoritative database outside the training dataset; that is referred to, retrieved from, and augments the generation from the LLM model.

While RAG is a full framework and there are 100s of research and industrial work done on it since its inception with meta researchers[7], in short, RAG works on 3 fronts:

1. creating a separate database of information specific to the use-case of the LLM model

2. optimizing retrieval of information from the said database using vector database architecture and advanced searching and indexing techniques (very active research area)

3. getting outputs using the retrieved information and an enhanced prompt from the rudimentary prompt provided by an end user to get the most optimized output (active research area on how to enhance prompt, how to best use the information retrieved and other interlinking concepts here)

We will try to discuss RAG in another article later but for the scope of this article we will limit the discussion here. Interested readers can refer to the further reads [7], [8] and [9].

What are SLM?

Other than this, other researches started with reducing LLM sizes and inference speeds to get faster, smaller and better models for specific use-cases. From this research front, we come up with new set of models called SLM (small language models), typically having only a few billion parameters and lower GBs in sizes (1-10GB range).

Conclusion:

There is a lot more work that is going on into understanding hallucination, reducing model sizes, defining advanced model performances. Can we write codes automatically with GPT-3?

Introduction:

OpenAI created and released the first versions of GPT-3 back in 2021 beginning. We wrote a few text generation articles that time and tested how to create tinder bio using GPT-3. If you are interested to know more on what is GPT-3 or what is openai, how the server look, then read the tinder bio article.

In this article, we will explore Code generation with OpenAI models.

It has been noted already in multiple blogs and exploration work, that GPT-3 can even solve leetcode problems. We will try to explore how good the OpenAI model can "code" and whether prompt tuning will improve or change those performances.

Basic coding:

We will try to see a few data structure coding performance by GPT-3.

Although we try a higher temperature with similar length, and this time it only comes up with a pseudo code. So, it is not so sure to come up with concrete code always.

This is funny as it does a separate but better implementation of linked list. But it seems to have captured the proper implementation of data structures. We are not checking how much of this is from memories, but this kind of code, seems to be a thing which is coming totally off the memory though. So, now, we will leave the basics and enter simple programs.

We aren't going to enter into direct long text programming questions, since that will need a lot of reasoning, so we will go to questions which test simple implementations in simple languages. Let's try, for example, fibonacci series questions.

Conclusion:

Simply it makes sense to say that GPT-3 can code like a beginner given no help and explicit prompt about programming. But to make it create code for further complicated stuff, i.e. language problems, will be challenging. So, we will have to find more prompt engineering as well as ideas on how to crack a long problem down automatically to use GPT-3 for the rest. For this, I will be writing another follow-up blog on the same topic. Stay tuned for the same.

spacy ner introduction and usage

Introduction:

One of the main application of spacy is to perform named entity recognition or ner activity with it. Named entity recognition stands for the NLP task where we detect named entity or entities such as organization, person, location etc different entity names. Spacy provides built-in methods to detect named entity recognition. In this article, we will go through the basics of detecting the different ner and using the spacy ner features.

What is NER and what are the different labels?

NER or named entity recognition, is the procedure to detect named entities using natural language processing algorithms. In spacy, universal ner labels are detected by default. So there are the following ner in this ner label list:

(1) PERSON: this represents any kind of person. This includes fictional and real people. fictional basically refers to cartoon, movie or book characters etc.

(2) NORP: nationalities or religious or political groups. This refers to basically a type of community of people again. This is sometime confusing as nationalities and name of countries are similar many times. But this doesn't refer to a geographical inanimate object, rather refers to a community or a group of people.

(3) FAC: this refers to some special type of locations or places which are mainly man made. For examples, buildings, airports, highways, bridges etc. There can seem to be a overlap of this and normal location; but the main difference is that FAC are man made while locations are more of geographical and natural.

(4) ORG: this refers to different types of organizations. For example, companies, agencies, institutions, academies etc fall in this category.

(5) GPE: this stands for geo-political entities. These are entities which has some sort of authoritative figure and governing body along with a geographical existence. These also can be apparently seen as locations; but the presence of authoritative figures or an administrative political body is the defining difference. Examples include states, cities, countries etc.

(6) LOC: this stands for locations which are non-GPE. This can have places, mountain ranges, forests, water bodies etc.

(7) PRODUCT: this almost follows the english meaning of the word product. Includes different objects, vehicles, foods, etc. This doesn't include any sellable services though.

(8) EVENT: this also follows the simple english interpretation. Examples include named hurricanes, game tournaments, battles, wars, etc.

(9) WORK_OF_ART: this refers to any object (physical or virtual) which entitles a artistic work. This can include titles of books, songs, named famous paintings etc.

(10) LAW: this quite simply refers to law which are basically named documents or pieces of papers turned into law.

(11) LANGUAGE: any spoken or communicated language falls in this category.

Rest are also pretty straight forward as (12) DATE (13) TIME (14) PERCENT (15) MONEY (16) QUANTITY (17) ORDINAL (18) CARDINAL.

So this is the most detailed and granular level of ner tags. One can reduce this down; by clubbing multiple tags together; for example, all ordinal, cardinal, percent, quantity back to numbers. date, time into times and so on. The most basic formats of ner tagging includes person, location and numbers.

Can I create custom entity?

Obviously one can create custom entity and train a spacy ner model to detect those custom ner entities too. This is what we call a blank entity model training. How to train spacy ner models with your custom data is extensively discussed in the part 4 of our spacy training series blogs.

When creating your own custom entities; you should albeit take a caution that the entities should be non-overlapping; i.e. one shouldn't tag same thing with two entities. Another thing is advised to do is that when training custom entities, make sure they aren't too niche. For example, if you are training to detect clothes from unstructured text data; then instead of training for bell bottom pants, or capri pants, maybe train for only pants to begin with.

This also refers to the idea that, you may have small amount of data; therefore it is always good to start training from top to bottom approach instead of bottom to top approach. i.e. start with more umbrella and smaller number of entities and only if that performs very good then try going one step down.

How to extract names or other ners from spacy?

Let's assume for the article's sake that we are mainly talking about english spacy. In english models, such as spacy's small model en_core_web_sm or the larger model en_core_web_lg; we get the ner tagging by default in the default pipeline. So once you make the doc by passing the text through the model; only you have to fetch the entities using the attribute doc.ents. A sample code will be like this below:

Clearly, the ents attribute stores all the detected entities; including names; and looping through it reveals which tokens or combination of tokens are detected as that entity.

Comparison with other libraries:

When we talk about packages or services which provide ner tagging and annotation; stanfordnlp, nltk, flair are a few to name as an alternative. But generally, if you are not doing a task where above 90% difference of accuracy matters way too much; there spacy is pretty good. In some cases ( not statistically or experimentally proven and just an empirical experience), flair and stanfordnlp may perform better.

But with the speed, option to train on top of baseline and nominal difference with other package performance, it is clear that spacy is the winner for this task as well.

How does spacy ner models work?

Spacy hasn't officially published the structure of exactly how their model architecture is. The latest version 3.1 and above spacy models applies transformer architecture and are trained using transformer model. Before that, spacy would use deep neural networks with specific speed optimization techniques. For further details, try to read spacy blogs. We also have embedded this video from spacy's author Matthew Honnibal; where they talk about spacy models work.

So in this article, we discussed what NER is, what are the different entities spacy models are trained against and what do they stand for. We also brushed with questions such as whether spacy ner is fast enough, whether you can train custom entities with spacy etc. We also touched the question on how the models work and embedded a video where spacy's author discusses how the models are trained; with a focus on the ner model's structure. Pyarabic: python package for Arabic language

Introduction:

In languages which are non-english and non-european as well, NLP work has progressed slowly in the last few decades because of the lesser number of scholars working on them as well as a lack of global interest in them. But now the time has changed and people from all over the world are collaborating on these lesser explored libraries and they are building resources for working on these languages with the same ease with that of english.

Pyarabic is a package created from such a similar effort which deals with the intricate details of the arabic language and helps processing all kinds of arabic texts. While trying to learn it, being from a non-arab background, I couldn't read lots of parts of the main readthedocs site and had to work my around it. So in this blog post, I will summarize my learnings in english language, so that you can learn it and use the package with much more ease than me.

Features:

First things first; lets get our basics known. The pyarabic package is written by taha zerrouki (http://tahadz.com/). Here are the following features mentioned for this library:

Arabic letters classification
Text tokenization into words or sentences
Strip Harakat ( all, except Shadda, tatweel, last_haraka)
Sperate and join Letters and Harakat
Reduce tashkeel
Mesure tashkeel similarity ( Harakats, fully or partially vocalized, similarity with a template)
Letters normalization ( Ligatures and Hamza)
Numbers to words
Extract numerical phrases
Pre-vocalization of numerical phrases
Unshiping texts

So, basically all the basic NLP stuff. But to know more into what these tasks stand for, we have to know what harakat, tashkeel and all other terms stand for.

Harakat/tashkeel:

Harakat translates to short vowel in arab. There are different vowels such as shadda, tanween etc which sit on the arabic letters and change their meaning.

Cases:

There are no upper case or lower cases in arabic.

How to tokenize arabic text?

I think in NLP, the most bare minimum thing to achieve is to do tokenization of texts. For arabic, you can simply do the following:

and simply the text_tokenized will have the list of tokens.

The tokenize function also allows different morph ( transformation and modification of the text) and conditions. The morph and conditions take both strings of function names which are built in to the pyarabic package or callable/lambda functions directly passed to be used for tokenization. Let's explore it with 2 examples from each.

Also, one can use the sentence_tokenize method to break down a paragraph or so into the different sentences. Checkout the below example for the same:

There are other utility functions related to tokenization; but you can check the documentation or figure out using simple python code yourself only. Next lets check how to handle numbers in arabic using this package.

how to extract numbers and deal with numbers:

There is a specific number.py file in the pyarabic language. All the number manipulations are done using this script from the package.

Let's take a look into a few use cases.

(a) how to turn arabic numbers into strings using pyarabic?

Here we use int2str function from the ArNumbers class of the number.py file of the pyarabic package. Check out the example below how it spells out 125.

(b) how to turn arabic text into numbers using pyarabic?

For this we use text2number function from the number.py script. In this example, it changes the spelled out number into western digits 523.

The necessary function for this is extract_number_phrases. Check the example below. It finds out 2 different number phrases from the given text string.

(d) How to normalize all types of numerals into same numeral format?

For this we will have to use a different script which is for translation, named as trans. You can use it like

So these are the different kind of number manipulations one can do with pyarabic. Let's focus on other things.

It is known that, in arabic, it is often normal to write without the tashkeel or the harakats. A bunch of different functions are there to help us normalize our texts therefore by stripping it off those vowels and thereby normalizing them.

So let's take into a look into

Normalizing arabic texts by removing vowels:

(a) stripping diacritics:

Most of the times, the vowels are applied as diacritic marks on the arabic text. To strip diacritic therefore means removing harakat and small letters. You can use strip_diacritics function for the same just like below:

(b) reducing tashkeel :

In this case we only delete the tashkeels. The function to use for this is reduce_tashkeel. Check how we are using it below:

(d) other than these, there are normalizing functions such as normalize_hamda and so on. For learning about them and what specific cases they are used in, you can follow the official documentation.

Conclusion:

In this article, we have briefly explored what pyarabic is, how to manipulate and tokenize text, count or transform numbers into string and vice versa; and how to handle vowel normalization and vowel stripping which is a specific characteristic to the arabic language itself. This is good enough to get you started with some real nlp in arabic. But note that further critical attributes such as sentence parsing, parts of speech tagging are not provided by this library currently; which makes this library significantly weaker to the general comparison in other language's dominant libraries. But withstanding that, pyarabic stands for the first big nlp library for arabic natural language processing toolkits.

java learning first step: in comparison to python

Introduction:

I didn't start my career with java, but with python and a bit of C. Then years after, I am learning java for android projects. In this blog, I will point out how I am learning java and also a little bit of resources and information along the way to help you learn.

This is more for a person who already is familiar with the programming concepts but is getting accustomed with the java syntax. Also it only spans to very basic and if people like it then only I will proceed with further details. I have taken guidance and screenshots from the android course by rob percieval for this blog. If you want to learn android, do take his course.

Thanks and lets begin.

Initial observations:

(1) a java code needs to have a class to start with. Also each class has method or functions associated to a class. among these methods, it must have the main method.

(2) void means it returns nothing.

(3) static means some variable which doesn't change at all. it is only dependent on the class, and not on the instance. which also means that it will be same across instances and can't be changed.

(4) println stands for print a line.

Data types: primitive and derivatives:

primitive types are char, int, double, boolean, byte, long and short. these are the similar types we use in c, c++ or any other similar strong typed language. java is also a strong typed language, hence all the types.

But String myname = 'rob';

this assignment has string starting with capital letter as string is not a primitive type. 'String' is a char array, and it is actually a class in java. Also, java allows string concatenation simply, just like python. for example, look at this little example below:

also, primitives like int can be implicitly converted while printing unlike python or javascript. for example look into this below:

also, we can call methods of a class, even the simple ones also; just like we do in python. see how we use length() of a string using this process:

a simple task involving all the variables:

Arrays in java:

seems like that java uses curly bracket to write array. also you can't directly print this. But good thing again is that it uses 0 to start indexing.

simple array is unmutable. so you can't change them.

for using list in java, we need to import java.util.* to use all the java items. Now, we can use list by using ArrayList().

so it will work like this:

List listName = new ArrayList();

simply add is the method for adding items.

listName.add(1); listName.add(2); so on.

list.get(index_no) gives you the index_no element from the list.

list.remove(index_no) is a pop from python.

list.toString() is also good.

a small task:

so basically, Arraylist() is the type. add is the new append. remove is the pop. and get is for getting specific index. tostring is a method not there in python ( at least I don't know of).

oh before we move on, java, doesn't take or I will say accept single quotes. strings are not defined in java with single quotes. I find it weird but maybe that's how it is.

Dictionaries in java:

Map map = new HashMap();

Map.put(father, "rob");

also Map allows Map.size() telling you the length of it.

Map.toString() lets you print it.

Map.remove('key') lets you remove a specific key. Basically an equivalent to del Map['key']

Rob didn't provide any tutorial for map procedure.

Now we will be learning conditionals.

If

simple if works in the following syntax:

if(condition) { //code block}

if else works in the following syntax

if(condition){//code block}else(condition){//code block}

Now, rob gave a simple task here. create a list of two integers; and then compare them and print which one is bigger.

I tried it with ArrayList but failed. It seems that I struck an error named

java.lang.object is bad operand for >

But why does this occur?

this occurs because arraylist elements are non-primitive. and you can't do operator overloading in java like in python; so you would have to use something called comparable.

A detailed description of it is provided here.

Next up: while loop:

syntax:

while(condition){code}

please consider for this type of loop that it surely ends. otherwise you would keep looping for infinite and crash browser/laptop/ide etc.

Sure. Now, let's see more.

We will try the simple "print the even numbers" question which rob gives as assignment.

interesting fact x++ works in java too. i.e. the "++" increment. So questions related to x = x+1 and x++ problems can be asked too for java interviews.

For loop:

for loop is exactly similar to the c format. the syntax is:

for(datatype variable = startpoint; variable endpoint condition; variable -- or ++) {codeblock}

A bit more complicated example, where we solve the task given by rob to solve triangular numbers.

Machine learning with pyspark

Introduction:

In this last post, we discussed the basics of pyspark. Now, in this post, we will discuss how to do machine learning in pyspark. We will discuss what are the main machine learning pipeline elements, and how to use them too. The content is taken from datacamp ditto, and the sole credit of writing the blocks go to datacamp pyspark course. I am merely compiling it together for you to go through fast and learn quickly, with the completed exercises and the full flow.

Machine Learning Pipelines

You'll step through every stage of the machine learning pipeline, from data intake to model evaluation. Let's get to it!

At the core of the pyspark.ml module are the Transformer and Estimator classes. Almost every other class in the module behaves similarly to these two basic classes.

Transformer classes have a .transform() method that takes a DataFrame and returns a new DataFrame; usually the original one with a new column appended. For example, you might use the class Bucketizer to create discrete bins from a continuous feature or the class PCA to reduce the dimensionality of your dataset using principal component analysis.

Estimator classes all implement a .fit() method. These methods also take a DataFrame, but instead of returning another DataFrame they return a model object. This can be something like a StringIndexerModel for including categorical data saved as strings in your models, or a RandomForestModel that uses the random forest algorithm for classification or regression.

Data types

Good work! Before you get started modeling, it's important to know that Spark only handles numeric data. That means all of the columns in your DataFrame must be either integers or decimals (called 'doubles' in Spark).

When we imported our data, we let Spark guess what kind of information each column held. Unfortunately, Spark doesn't always guess right and you can see that some of the columns in our DataFrame are strings containing numbers as opposed to actual numeric values.

To remedy this, you can use the .cast() method in combination with the .withColumn() method. It's important to note that .cast() works on columns, while .withColumn() works on DataFrames.

The only argument you need to pass to .cast() is the kind of value you want to create, in string form. For example, to create integers, you'll pass the argument "integer" and for decimal numbers you'll use "double".

You can put this call to .cast() inside a call to .withColumn() to overwrite the already existing column, just like you did in the previous chapter!

Create a new column

In the last exercise, you converted the column plane_year to an integer. This column holds the year each plane was manufactured. However, your model will use the planes' age, which is slightly different from the year it was made!

Create the column plane_age using the .withColumn() method and subtracting the year of manufacture (column plane_year) from the year (column year) of the flight.

Making a Boolean

Consider that you're modeling a yes or no question: is the flight late? However, your data contains the arrival delay in minutes for each flight. Thus, you'll need to create a boolean column which indicates whether the flight was late or not!

Instructions

Use the .withColumn() method to create the column is_late. This column is equal to model_data.arr_delay > 0.
Convert this column to an integer column so that you can use it in your model and name it label (this is the default name for the response variable in Spark's machine learning routines).
Filter out missing values (this has been done for you).

Strings and factors

As you know, Spark requires numeric data for modeling. So far this hasn't been an issue; even boolean columns can easily be converted to integers without any trouble. But you'll also be using the airline and the plane's destination as features in your model. These are coded as strings and there isn't any obvious way to convert them to a numeric data type.

Fortunately, PySpark has functions for handling this built into the pyspark.ml.features submodule. You can create what are called 'one-hot vectors' to represent the carrier and the destination of each flight. A one-hot vector is a way of representing a categorical feature where every observation has a vector in which all elements are zero except for at most one element, which has a value of one (1).

Each element in the vector corresponds to a level of the feature, so it's possible to tell what the right level is by seeing which element of the vector is equal to one (1).

The first step to encoding your categorical feature is to create a StringIndexer. Members of this class are Estimators that take a DataFrame with a column of strings and map each unique string to a number. Then, the Estimator returns a Transformer that takes a DataFrame, attaches the mapping to it as metadata, and returns a new DataFrame with a numeric column corresponding to the string column.

The second step is to encode this numeric column as a one-hot vector using a OneHotEncoder. This works exactly the same way as the StringIndexer by creating an Estimator and then a Transformer. The end result is a column that encodes your categorical feature as a vector that's suitable for machine learning routines!

This may seem complicated, but don't worry! All you have to remember is that you need to create a StringIndexer and a OneHotEncoder, and the Pipeline will take care of the rest.

Carrier

In this exercise you'll create a StringIndexer and a OneHotEncoder to code the carrier column. To do this, you'll call the class constructors with the arguments inputCol and outputCol.

The inputCol is the name of the column you want to index or encode, and the outputCol is the name of the new column that the Transformer should create.

Instructions

Create a StringIndexer called carr_indexer by calling StringIndexer() with inputCol="carrier" and outputCol="carrier_index".
Create a OneHotEncoder called carr_encoder by calling OneHotEncoder() with inputCol="carrier_index" and outputCol="carrier_fact".

Destination

Now you'll encode the dest column just like you did in the previous exercise.

Create a StringIndexer called dest_indexer by calling StringIndexer() with inputCol="dest" and outputCol="dest_index".
Create a OneHotEncoder called dest_encoder by calling OneHotEncoder() with inputCol="dest_index" and outputCol="dest_fact".

Assemble a vector

The last step in the Pipeline is to combine all of the columns containing our features into a single column. This has to be done before modeling can take place because every Spark modeling routine expects the data to be in this form. You can do this by storing each of the values from a column as an entry in a vector. Then, from the model's point of view, every observation is a vector that contains all of the information about it and a label that tells the modeler what value that observation corresponds to.

Because of this, the pyspark.ml.feature submodule contains a class called VectorAssembler. This Transformer takes all of the columns you specify and combines them into a new vector column.

Instructions

Create a VectorAssembler by calling VectorAssembler() with the inputCols names as a list and the outputCol name "features".
- The list of columns should be ["month", "air_time", "carrier_fact", "dest_fact", "plane_age"].

You're finally ready to create a Pipeline!

Pipeline is a class in the pyspark.ml module that combines all the Estimators and Transformers that you've already created. This lets you reuse the same modeling process over and over again by wrapping it up in one simple object. Neat, right?

Import Pipeline from pyspark.ml.
Call the Pipeline() constructor with the keyword argument stages to create a Pipeline called flights_pipe.
- stages should be a list holding all the stages you want your data to go through in the pipeline. Here this is just: [dest_indexer, dest_encoder, carr_indexer, carr_encoder, vec_assembler]

Transform the data

Hooray, now we're finally ready to pass your data through the Pipeline you created!

Create the DataFrame piped_data by calling the Pipeline methods .fit() and .transform() in a chain. Both of these methods take model_data as their only argument.

Split the data

Now that you've done all your manipulations, the last step before modeling is to split the data!

Use the DataFrame method .randomSplit() to split piped_data into two pieces, training with 60% of the data, and test with 40% of the data by passing the list [.6, .4] to the .randomSplit() method.

What is logistic regression?

The model you'll be fitting in this chapter is called a logistic regression. This model is very similar to a linear regression, but instead of predicting a numeric variable, it predicts the probability (between 0 and 1) of an event.

To use this as a classification algorithm, all you have to do is assign a cutoff point to these probabilities. If the predicted probability is above the cutoff point, you classify that observation as a 'yes' (in this case, the flight being late), if it's below, you classify it as a 'no'!

You'll tune this model by testing different values for several hyperparameters. A hyperparameter is just a value in the model that's not estimated from the data, but rather is supplied by the user to maximize performance. For this course it's not necessary to understand the mathematics behind all of these values - what's important is that you'll try out a few different choices and pick the best one.

Create the modeler

The Estimator you'll be using is a LogisticRegression from the pyspark.ml.classification submodule.

Import the LogisticRegression class from pyspark.ml.classification.
Create a LogisticRegression called lr by calling LogisticRegression() with no arguments.

Cross validation

In the next few exercises you'll be tuning your logistic regression model using a procedure called k-fold cross validation. This is a method of estimating the model's performance on unseen data (like your test DataFrame).

It works by splitting the training data into a few different partitions. The exact number is up to you, but in this course you'll be using PySpark's default value of three. Once the data is split up, one of the partitions is set aside, and the model is fit to the others. Then the error is measured against the held out partition. This is repeated for each of the partitions, so that every block of data is held out and used as a test set exactly once. Then the error on each of the partitions is averaged. This is called the cross validation error of the model, and is a good estimate of the actual error on the held out data.

You'll be using cross validation to choose the hyperparameters by creating a grid of the possible pairs of values for the two hyperparameters, elasticNetParam and regParam, and using the cross validation error to compare all the different models so you can choose the best one!

Create the evaluator

The first thing you need when doing cross validation for model selection is a way to compare different models. Luckily, the pyspark.ml.evaluation submodule has classes for evaluating different kinds of models. Your model is a binary classification model, so you'll be using the BinaryClassificationEvaluator from the pyspark.ml.evaluation module.

This evaluator calculates the area under the ROC. This is a metric that combines the two kinds of errors a binary classifier can make (false positives and false negatives) into a simple number. You'll learn more about this towards the end of the chapter!

Instructions

Import the submodule pyspark.ml.evaluation as evals.
Create evaluator by calling evals.BinaryClassificationEvaluator() with the argument metricName="areaUnderROC".

Make a grid

Next, you need to create a grid of values to search over when looking for the optimal hyperparameters. The submodule pyspark.ml.tuning includes a class called ParamGridBuilder that does just that (maybe you're starting to notice a pattern here; PySpark has a submodule for just about everything!).

You'll need to use the .addGrid() and .build() methods to create a grid that you can use for cross validation. The .addGrid() method takes a model parameter (an attribute of the model Estimator, lr, that you created a few exercises ago) and a list of values that you want to try. The .build() method takes no arguments, it just returns the grid that you'll use later.

Make the validator

The submodule pyspark.ml.tuning also has a class called CrossValidator for performing cross validation. This Estimator takes the modeler you want to fit, the grid of hyperparameters you created, and the evaluator you want to use to compare your models.

The submodule pyspark.ml.tune has already been imported as tune. You'll create the CrossValidator by passing it the logistic regression Estimator lr, the parameter grid, and the evaluator you created in the previous exercises.

Instructions

Create a CrossValidator by calling tune.CrossValidator() with the arguments:
- estimator=lr
- estimatorParamMaps=grid
- evaluator=evaluator
Name this object cv.

Fit the model(s)

You're finally ready to fit the models and select the best one!

Unfortunately, cross validation is a very computationally intensive procedure. Fitting all the models would take too long on DataCamp.

To do this locally you would use the code:

# Fit cross validation models
models = cv.fit(training)

# Extract the best model
best_lr = models.bestModel

Remember, the training data is called training and you're using lr to fit a logistic regression model. Cross validation selected the parameter values regParam=0 and elasticNetParam=0 as being the best. These are the default values, so you don't need to do anything else with lr before fitting the model.

Instructions

Create best_lr by calling lr.fit() on the training data.
Print best_lr to verify that it's an object of the LogisticRegressionModel class.

Evaluating binary classifiers

For this course we'll be using a common metric for binary classification algorithms call the AUC, or area under the curve. In this case, the curve is the ROC, or receiver operating curve. The details of what these things actually measure isn't important for this course. All you need to know is that for our purposes, the closer the AUC is to one (1), the better the model is!

Instructions

Use your model to generate predictions by applying best_lr.transform() to the test data. Save this as test_results.
Call evaluator.evaluate() on test_results to compute the AUC. Print the output.

In this course, we covered basic sql querying in the first part and then we went ahead and covered transforming data, training model and finally cross validating, grid searching and evaluating the result to finalize that model.
